RAG System - Production-Ready Retrieval Augmented Generation

A comprehensive RAG system with advanced reasoning capabilities, built with LangChain, FAISS, and Claude Sonnet 4.

This is a complete RAG implementation featuring:

  • Phase 1: RAG Foundation ✅
  • Phase 2: Enhanced RAG with Agent Reasoning ✅
  • Phase 3: MCP Integration (Planned)

📋 Prerequisites

  • Python 3.10+ (tested on Python 3.14)
  • OpenAI API key (for embeddings)
  • Anthropic API key (for Claude Sonnet 4)

🚀 Quick Start

1. Installation

# Clone or navigate to project
cd rag-system

# Create virtual environment
python -m venv venv

Pipeline Presets

Minimal (Fastest):

⚙️ Configuration

All settings can be configured via environment variables or src/config/settings.py:

Phase 1 Settings

  • CHUNK_SIZE: Maximum tokens per chunk (default: 1000)
  • CHUNK_OVERLAP: Overlap between chunks (default: 200)
  • RETRIEVAL_TOP_K: Number of documents to retrieve (default: 4)
  • LLM_MODEL: Claude model (default: claude-sonnet-4-20250514)
  • LLM_TEMPERATURE: Generation temperature (default: 0.0)

Phase 2 Settings 🆕

  • ENABLE_QUERY_REWRITING: Enable query optimization (default: true)
  • ENABLE_MULTI_QUERY: Enable multi-query generation (default: true)
  • ENABLE_RERANKING: Enable document re-ranking (default: true)
  • ENABLE_REACT_AGENT: Enable ReAct agent (default: false)
  • ENABLE_SELF_CRITIQUE: Enable self-critique (default: true)
  • MULTI_QUERY_COUNT: Number of query variations (default: 3)
  • RERANK_TOP_K: Documents to keep after re-ranking (default: 5)
  • REACT_MAX_ITERATIONS: Maximum ReAct iterations (default: 5)

Phase 1 Learnings

  1. Text Splitting: Recursive splitting preserves semantic coherence
  2. Embedding Consistency: Always use same model for documents and queries

  5. Quality Gating: Self-critique catches hallucinations and poor answers before user sees them
  6. Feature Toggles: Per-query feature control allows speed/quality tradeoffs
  7. Cost vs Quality: Standard preset offers best value (~50% quality gain, modest latency)

🔍 Common Issues

Phase 1 Issues

  • "No relevant documents found": Lower score threshold or use more specific queries
  • "Context too long": Reduce top_k or chunk_size
  • "API Key Error": Check .env file has correct keys

Phase 2 Issues 🆕

  • Slow queries: Disable expensive features (multi-query, ReAct agent)
  • High API costs: Use "standard" preset instead of "full"
  • Self-critique too strict: Adjust quality thresholds in self_critique.py
  • Multi-query duplication: Increase top_k for base retriever
